AI Systems Making Progress in Code Generation

Artificial Intelligence (AI) is focused on developing computer programs that can address complex problems. One area of progress is the use of Large Language Models (LLMs) to generate and comprehend code and text. While LLMs have been successful in handling straightforward programming tasks, they struggle with more difficult problems. This is because they provide code solutions as monolithic blocks, rather than breaking them down into logical subtasks and reusable sub-modules. In contrast, human programmers naturally write modular and abstract code, using previously created modules to expand their expertise.

To bridge this gap between LLMs and human developers, researchers at Salesforce Research have introduced CodeChain. This framework encourages LLMs to write modularized code using a chain-of-thought approach. It incorporates a sequence of self-revisions driven by representative sub-modules from earlier iterations. CodeChain consists of two iterative phases: Sub-Module Extraction and Clustering, and Prompt Augmentation and Re-Generation.

In the first phase, sub-modules are identified and arranged into clusters based on the code produced by the LLM. Representative sub-modules are then selected for their wider applicability and reusability. In the second phase, the initial chain-of-thought prompt is enhanced and regenerated by integrating the chosen module implementations. The LLM is then instructed to produce fresh modularized solutions.

CodeChain has significantly improved code generation. It emphasizes modularity and accuracy by encouraging the LLM to build upon and reuse pre-existing, verified sub-modules. It has shown relative pass@1 improvements of 35% on APPS and an impressive 76% on CodeContests. These gains have been observed in various LLMs, including open-source models.

Comprehensive studies have been conducted to understand the factors contributing to CodeChain’s success. These studies have examined prompting techniques, the number of clusters used, the sizes of the LLM models, and the quality of the generated programs. The insights obtained from these investigations have shed light on why CodeChain is effective in enhancing the caliber and modularity of code produced by LLMs.

In summary, CodeChain is a revolutionary framework that bridges the gap between LLMs and seasoned human programmers. By promoting modularity and facilitating self-revisions through the reuse of sub-modules, CodeChain improves the process of generating code using large language models.
